Hello!
A few months ago I bought some AirPods that were labeled and appeared as genuine and worked relatively well initially, however they recently broke and I took them for repair to an apple store to learn they were fake. This is unfortunately just outside of the eBay guarantee window and the sellers account has since been closed so there is no way to contact them. Is there anything I can do?? The product was still fake when I bought it, I just hadn’t known it yet.

If it's an option @thepanicprince you have 180 days to file a dispute here. Go back right away and click Escalate to PayPal at the bottom of the dispute. Then await further instructions.
Otherwise, file a Defective or Not as described chargeback with your card issuer (call the number on the back of the card).

Sorry, it's probably to late for any help from Ebay.
If you paid using Pay Pal, you have 180 days to open a case with them.
If not, try your credit card.
